I’m using QGIS to get villages/ towns/ settlements of a specific area from OpenStreetMap. Is there any way to extract places with their elevation data? I see that most of my elevation data in attribute table are missing.

OSM doesn’t try to be a comprehensive source of elevation data, and as you’ve found, the “ele” tag is only lightly used. Maps that show contour lines and/or slope shading (eg openandromaps, opencyclemap) get detailed elevation data from another source, and mash that up with the OSM data.
